Also, make sure to include data that is representative of the entire population the model is expected to serve. Use techniques like oversampling or generating synthetic data to increase the representation of minority or under-represented classes in the training set.

- Algorithmic Bias and Ethical Considerations
Data bias or algorithmic bias in healthcare AI is another factor that affects the accuracy of AI tools. Data bias happens when AI models are trained on data not representative of the real-world population or containing historical and systemic prejudices.
For example, a commercial AI algorithm, widely used by US hospitals and health systems to predict which patients would benefit most from high-risk care management programs, was found to be racially biased. The reason for this was that the AI system was trained in biased proxy variables — the algorithm was designed to predict a patient’s future healthcare costs (how much money would be spent on them), not their actual severity of illness (how sick they were). And historically, less money is spent on black patients compared to white patients with the same chronic illnesses and needs, due to systemic access barriers, implicit bias in care, and lower socioeconomic status. Hence the algorithm, trained on this historical expenditure data, learnt to associate being white with higher projected costs (and thus higher predicted risk) and being black with lower projected costs (and thus lower predicted risk), even when their actual health was identical or the black patient was sicker. As a result, the AI system systematically recommended healthier white patients for the high-risk care management programs ahead of sicker Black patients. Now, this undermines both effectiveness and ethics.
- Explainability, Clinician Trust, and Actionability
AI models must be able to inspire trust in patients as well as clinicians and healthcare professionals who use them. They find “black-box” models difficult to trust, especially when decisions affect resource allocation or patient management. Adoption of AI must come from understanding and confidence, and for this, explainability is a major factor—AI must be able to answer not just “what” but also “why.”
- Workforce Training for AI in Healthcare
AI enhances and augments human capabilities and doesn’t replace jobs. But yes, a change in the way one works cannot be avoided, but it is essential—data scientists, public health analysts, and frontline workers would be required to acquire new skills. There’s a significant gap between the technical capabilities of AI and the human resources available to effectively deploy and utilize these tools. The pace of AI adoption would be impeded if users don’t see value or fear job displacement.

Healthcare data is highly sensitive, and strict regulations like HIPAA in the US and GDPR in Europe govern its collection, storage, and use.
